# Geometric Foundation Multiview

> Replace traditional VAE latent spaces with frozen geometric foundation model encoders (e.g., Depth Anything 3) as diffusion latent space. Leverage strong cross-view geometric correspondences for multi-view consistency. Use cascaded generation up to optimal boundary layer, then deterministically derive deeper features from frozen encoder, resulting in 4.4× faster convergence with superior geometric consistency compared to VAE-based approaches.

## Component Identification

**Old Design (VAE-Based Diffusion)**
- VAE encoder compresses image to latent space
- Diffusion operates in view-independent VAE latent space
- Separate VAE encoder and decoder for encoding/decoding cycle
- No inherent 3D structure or geometric correspondence

**New Design (Geometric Latent Diffusion)**
Frozen geometric foundation model encoder replaces VAE encoder; diffusion operates in geometric feature space with inherent cross-view correspondences.

## Motivation & Problem Statement

Multi-view image synthesis requires maintaining geometric consistency across views—positions, occlusions, and 3D structures must align. VAE latent spaces are view-independent and lack geometric structure. Geometric foundation models (trained on depth, surface normals, 3D geometry) encode strong cross-view geometric correspondences. Leveraging this structure accelerates convergence and improves consistency.

## The "Swap" Mechanism

**Traditional Multi-View Diffusion:**
```
Input image
    ↓
VAE encoder (learned, random initialization)
    ↓
Diffusion in VAE latent space
    ↓
VAE decoder
    ↓
Output image
```

**Geometric Latent Diffusion (GLD):**
```
Input image
    ↓
Frozen geometric foundation encoder (Depth Anything 3)
    ↓
Diffusion in geometric feature space (up to boundary layer k)
    ↓
Feature propagation (deterministic)
    ↓
RGB decoder + geometric decoder
    ↓
Output images (multiple views)
```

**Key Swap Details:**

The substitution is not a direct encoder replacement—it's a **layered architecture swap**:

```python
# Traditional approach: full VAE cycle
latent = vae_encoder(image)  # Learned encoder
noisy_latent = add_noise(latent, t)
denoised = diffusion_model(noisy_latent, t)
output = vae_decoder(denoised)  # Learned decoder
# GLD approach: hybrid encoding/generation
# Foundation model provides geometric structure
geometric_features = frozen_encoder(image)  # 4-level hierarchy
# Boundary layer identification (optimal tradeoff)
# Layers 0-k: synthesize via diffusion
# Layers k+1-3: derive deterministically from frozen encoder
boundary_layer = identify_boundary(task, dataset)
# Cascaded generation
synthesized = diffusion_model(geometric_features[:boundary_layer], t)
# Deterministic feature propagation
propagated = frozen_encoder.propagate(synthesized)
# Derives deeper features from shallow ones using encoder internals
full_features = [synthesized, propagated]
# Multi-view decoders
rgb_output = rgb_decoder(full_features)
geometric_output = geometric_decoder(full_features)
```

## Enabling Multi-View Synthesis

**Cross-View Geometric Correspondences:**
Geometric foundation models inherently encode relationships between views:
- Depth maps align across viewpoints (same 3D structure)
- Surface normals preserve orientation consistency
- Point correspondences deterministic (same position, different camera)

This structure directly supports multi-view coherence without explicit 3D reasoning.

**Multi-Level Feature Hierarchy:**
Geometric encoders typically produce 4 feature levels (increasing receptive field, decreasing resolution):
- **Level 0** (finest): High-resolution, local geometry
- **Level 1**: Mid-level structure
- **Level 2**: Coarse semantic layout
- **Level 3** (coarsest): Global scene structure

**Boundary Layer Strategy:**
Rather than synthesizing all four levels, identify optimal boundary:
- Synthesize shallow features (need expressivity)
- Derive deeper features (deterministic from shallow via frozen encoder)
- Drastically reduces diffusion compute (synthesize fewer layers)

**Cascaded Generation Pattern:**
```
Level 0 synthesis (diffusion)
    ↓
Level 1 synthesis (diffusion conditional on L0)
    ↓
Level 2 propagation (deterministic from L0-L1)
    ↓
Level 3 propagation (deterministic from L0-L2)
    ↓
RGB + geometric decoders
```

Conditional generation preserves consistency: upper levels conditioned on lower levels ensure hierarchical coherence.

## Performance Improvements

### Convergence Speed
- GLD: **4.4× faster** than VAE-based baselines
- Geometric structure accelerates diffusion (fewer refinement steps needed)
- Frozen encoder provides strong initialization (no random encoder initialization)

### Geometric Consistency
- Superior view alignment (geometric correspondences preserved)
- Better occlusion consistency (3D structure guides generation)
- Reduced artifacts at view boundaries

### Architectural Efficiency
- Fewer trainable parameters (frozen encoder shared across views)
- Reduced memory (deterministic feature propagation cheaper than synthesis)
- Single geometric decoder for all views (vs. separate VAE for each view)

## Conditions of Applicability

**Works well when:**
- Geometric consistency is critical (multi-view synthesis, 3D-aware generation)
- Foundation model available for task (Depth Anything, midas, etc.)
- Batch size and memory allow frozen model caching
- Boundary layer can be empirically determined (may vary by dataset)

**Less optimal when:**
- Geometric structure irrelevant (non-spatial data, abstract content)
- Foundation model unavailable or incompatible (no pre-trained option)
- Real-time inference required (frozen encoder adds latency overhead)
- Domain mismatch (foundation trained on photos, task is medical/synthetic)
