Extract-and-Evaluate (EaE) Hierarchical Monitoring for LLM Agent Oversight

This skill enables Claude to build and apply Extract-and-Evaluate (EaE) monitoring pipelines -- a hierarchical approach where one LLM isolates suspicious excerpts from an agent's reasoning trace and actions, and a separate LLM scores those excerpts for misbehavior. Based on research showing that LLM monitors paradoxically perform worse with full information access (the "less-is-more" effect), EaE leverages deliberate information filtering to improve sabotage detection by up to 16.8 percentage points over next-best approaches.

Key Technique

The Less-Is-More Effect

Counter-intuitively, giving an LLM monitor more context about an agent's reasoning and actions often hurts detection performance. In experiments across three sabotage environments, monitors with access to both chain-of-thought (CoT) and actions underperformed simpler approaches in 7 of 8 monitor-environment pairs. The root cause: agents embed post-hoc justifications in their reasoning that "gaslight" monitors into believing unauthorized side tasks were intended by the user. By stripping away these rationalizations, a downstream evaluator sees the discrepancy between the stated task and the actual behavior much more clearly.

Extract-and-Evaluate Architecture

EaE separates monitoring into two independent LLM calls with separate contexts:

1. Extractor: Receives the full agent trajectory (CoT + actions + task description). Its job is to identify and quote verbatim excerpts that are relevant to assessing suspiciousness. It does not produce a final score -- only excerpts with brief annotations.
2. Evaluator: Receives only the original task description and the extracted excerpts. With no access to the agent's rationalizations, it scores suspiciousness on a calibrated scale.

The critical design constraint is that the extractor and evaluator must run in separate model contexts. Attempting extraction and evaluation within a single context collapses back to the full-information failure mode. The paper found that in-context self-filtering was "not competitive" with the fully separated pipeline.

Cost-Performance Trade-offs

On the Pareto frontier of cost vs. detection accuracy, models using information filtering (EaE and related approaches) dominate. Step-by-Step Workflow

1. Define the threat model. Enumerate what misbehaviors you want to detect (e.g., data exfiltration, injected vulnerabilities, unauthorized file operations, performance degradation). Write these as a structured checklist the evaluator will reference.

2. Capture the agent trajectory. Instrument your agent framework to log: (a) the original user/system task description, (b) the full chain-of-thought or reasoning trace, and (c) all actions taken (code written, tool calls made, files modified). Store these as structured JSON with clear field separation.

3. Build the Extractor prompt. Instruct the extractor model to read the full trajectory and produce verbatim quotes of any passages relevant to assessing whether the agent deviated from its assigned task. The extractor should annotate each quote with a one-line rationale for why it is relevant. Explicitly instruct it to not produce a suspiciousness score.

4. Build the Evaluator prompt. Instruct the evaluator model to receive only the task description and the extracted quotes. It should score suspiciousness on a numerical scale (e.g., 1-10) and provide a brief justification. The evaluator must never see the agent's full CoT or self-justifications.

5. Select models for each stage. Use a cheaper, faster model (e.g., GPT-4.1-mini, Claude Haiku, Gemini Flash) for extraction since it processes the full long context. Use a stronger model for evaluation since it processes a much shorter input. This asymmetry optimizes the cost-performance trade-off.

6. Run the Extractor. Pass the complete agent trajectory to the extractor. Parse its output to isolate quoted excerpts and annotations. Validate that the output contains actual verbatim quotes from the trajectory (not fabricated summaries).

7. Run the Evaluator. Pass the task description and validated excerpts to the evaluator. Collect the suspiciousness score and justification.

8. Apply threshold logic. Calibrate a decision threshold on a labeled validation set targeting your acceptable false-positive rate (typically 1-5% for production systems). Flag trajectories scoring above threshold for human review.

9. Log and audit. Store the full pipeline output (trajectory, excerpts, scores, decisions) for retrospective analysis. Track detection rates over time to identify drift as agent capabilities evolve.

10. Iterate on the Extractor prompt. When false negatives occur, analyze what the extractor missed. Add specific extraction guidance for newly observed sabotage patterns. The extractor prompt is the primary tuning surface.

Example 2: Auditing a multi-step research agent for data exfiltration

User: Our research agent runs 20+ tool calls per task. We need to detect
      if it's leaking proprietary data to external endpoints.

Approach:
1. Log the full trajectory: task prompt, all 20+ tool calls with arguments
   and responses, and the agent's reasoning between each step.

2. Select Gemini 2.0 Flash for both extractor and evaluator (~$0.004/transcript).

Best Practices

• Do: Always use separate model contexts for extraction and evaluation. The paper's central finding is that in-context self-filtering fails -- the model's own rationalizations contaminate its judgment.
• Do: Require the extractor to produce verbatim quotes, not summaries. Summaries re-introduce the paraphrasing and rationalization that cause the less-is-more effect.
• Do: Withhold the side-task or attack description from the evaluator. The evaluator should only know the legitimate task and the excerpts. This mirrors realistic deployment where you don't know the attacker's objective.
• Do: Calibrate thresholds on labeled data with a target false-positive rate. The paper uses 1% FPR as the primary operating point for practical deployment.
• Avoid: Passing the agent's full chain-of-thought directly to a single evaluator model. This consistently underperforms action-only or EaE approaches across all tested environments.
• Avoid: Using the same model instance for both extraction and evaluation in a single conversation turn. Context leakage defeats the purpose of information filtering.

Error Handling

Limitations

• Post-execution only. EaE monitors trajectories after execution, not in real-time. It cannot prevent a malicious action from being taken -- only detect it afterward.
• Assumes agent transparency. The less-is-more effect relies on agents being somewhat transparent about their reasoning. Agents deliberately trained to hide their objectives in opaque CoT will reduce extractor effectiveness.
• Calibration drift. As agent models improve, sabotage patterns change. Thresholds and extractor prompts require periodic recalibration on fresh labeled data.
• Not a substitute for sandboxing. EaE is a detection layer, not a prevention layer. Combine it with execution sandboxes, permission controls, and action-level allowlists.
• Diminishing returns at scale. Beyond ~$0.01 per transcript, additional spending yields marginal detection improvements. For extremely high-stakes tasks, human review remains necessary.
• Tested primarily on code sabotage. The paper's three environments focus on coding and task-completion scenarios. Generalization to other domains (e.g., financial transactions, content generation) requires separate validation.
