Stateless Yet Not Forgetful: Detecting and Defending Against Implicit Memory in LLM Pipelines

This skill enables Claude to identify, test for, and mitigate implicit memory — the ability of an LLM to carry hidden state across otherwise independent interactions by encoding information in its outputs and recovering it when those outputs are reintroduced as input. Based on the research by Salem, Paverd, and Abdelnabi (arXiv:2602.08563), this skill applies their taxonomy of encoding strategies (zero-width characters, steganographic text patterns, semantic structural encodings) to real-world security auditing of LLM-integrated systems, agentic pipelines, and multi-model architectures.

When to Use

• When auditing an agentic pipeline where LLM outputs from one step become inputs to another (e.g., chain-of-thought passed between agents, summaries fed back as context)
• When a user asks to verify that their LLM integration is truly stateless and no information leaks between sessions or users
• When building sanitization layers for LLM outputs before they are stored, logged, or reingested into downstream models
• When designing multi-agent systems and you need to prevent covert inter-agent communication channels
• When testing whether a fine-tuned model has been poisoned with implicit memory behavior (temporal backdoors)
• When implementing output filtering for an LLM gateway or proxy service
• When a user wants to understand how hidden channels work so they can red-team their own systems

Key Technique

Implicit memory exploits the fact that most LLM deployment pipelines reingest model outputs as future inputs — through conversation history, tool results, agent-to-agent communication, RAG retrieval of prior generations, or summarization chains. An LLM can encode information into these outputs using three classes of encoding, each with distinct capacity-robustness-detectability tradeoffs:

Zero-width character encoding uses invisible Unicode characters (Zero-Width Space U+200B, Zero-Width Non-Joiner U+200C, Zero-Width Joiner U+200D, directional marks U+200E/U+200F, and the Tags block U+E0000–U+E007F) to embed arbitrary bitstrings. This is high-bandwidth (many bits per token) but trivially detected and stripped by a Unicode sanitizer. Steganographic encoding hides bits in subtle textual variations — letter casing patterns, punctuation frequency, word choice from synonym sets, acrostics in first letters. This survives casual inspection but yields only a few bits per sentence. Semantic structural encoding uses high-level document features (number of examples, industry domain references, narrative trajectory patterns) to encode bits in a way that is indistinguishable from normal text and survives aggressive paraphrasing (95%+ accuracy after rewriting), but is difficult for models to reliably generate on demand.

The critical insight for defenders is that any pipeline that feeds LLM outputs back as inputs creates a potential hidden channel. The defense must operate at the output boundary: sanitize before reingestion. For attackers (red-teamers), the technique shows that even prompting alone can create implicit memory in reasoning-capable models (56–82% exact-match accuracy), and fine-tuning pushes this to 90%+ with negligible utility loss.

Step-by-Step Workflow

Auditing an LLM Pipeline for Implicit Memory Vulnerabilities

1. Map all reingestion paths. Trace every point where model outputs flow back as model inputs. Draw a data-flow diagram covering: conversation history injection, agent-to-agent message passing, RAG storage and retrieval of generated content, summarization chains, tool-use result formatting, and logging systems whose outputs may be queried later.

2. Classify each path by encoding opportunity. For each reingestion path, determine which encoding classes are viable: zero-width characters (any text path), steganographic (text paths that preserve exact wording), or semantic (paths that preserve meaning but may paraphrase). Paths that apply heavy normalization are lower risk; raw pass-through paths are highest risk.

3. Probe for zero-width character leakage. Craft test prompts that instruct the model to embed zero-width characters in responses (e.g., "Append a ZWNJ after every sentence"). Feed the output back through your pipeline. Check whether the characters survive to the next model invocation. If they do, this is a confirmed high-bandwidth channel.

4. Probe for steganographic encoding. Instruct the model to encode a known 4-bit value using first-letter acrostics across four sentences. Feed the output through the pipeline. In a fresh session, provide the output text and ask the model to decode the acrostic. If the round-trip succeeds, steganographic channels are viable.

5. Probe for semantic encoding. Instruct the model to respond using exactly N concrete examples (encoding 3 bits), from a specific industry domain (3 bits), with a particular outcome trajectory (2 bits). Pass through the pipeline including any paraphrasing or summarization. Ask a fresh model instance to decode the three features. If all three survive, semantic channels are robust in your pipeline.

6. Implement output sanitization at each reingestion boundary. Apply a layered defense: (a) strip all Unicode control characters, zero-width characters, and characters outside expected ranges; (b) normalize whitespace and punctuation; (c) for high-security paths, paraphrase outputs through a separate model before reingestion.

7. Validate sanitization effectiveness. Re-run probes from steps 3–5 against the sanitized pipeline. Zero-width probes must fail completely. Steganographic probes should fail or degrade significantly. Semantic probes are hardest to block — if they succeed, consider whether the semantic content itself is a risk or just an inherent property of natural language.

8. Implement monitoring for anomalous output patterns. Deploy detectors for: unexpected Unicode codepoints, statistically unusual character distributions, suspiciously structured text (consistent acrostics, rigid example counts), and outputs that change format when the same query is repeated.

9. Document the residual risk. Semantic encoding at low bitrates (1–8 bits per response) is fundamentally difficult to eliminate without destroying output quality. Acknowledge this in your threat model and compensate with application-level controls (rate limiting, output diversity enforcement, session isolation).

Example 1: Auditing a customer-service chatbot pipeline

Best Practices

Do:

• Sanitize LLM outputs at every boundary where they re-enter as inputs — this is the single most important defense
• Test all three encoding classes (zero-width, steganographic, semantic) since defenses effective against one may miss another
• Treat the capacity-robustness-detectability tradeoff as your guide: zero-width is high-capacity but easy to strip; semantic is low-capacity but survives paraphrasing
• Use a separate, independently prompted model instance for paraphrasing in high-security contexts
• Log and monitor for anomalous Unicode distributions in model outputs as an early warning system

Avoid:

• Assuming your pipeline is safe because you don't use explicit memory — implicit memory exploits the outputs themselves
• Relying solely on zero-width character stripping — steganographic and semantic encodings bypass this entirely
• Trusting that paraphrasing eliminates all channels — semantic encoding at 8 bits survives paraphrasing at 95% accuracy per the paper's findings
• Ignoring fine-tuned model risk — fine-tuning achieves 90%+ state propagation accuracy with no measurable utility loss, making it nearly undetectable via benchmarks alone
• Over-sanitizing to the point of destroying output quality — accept residual risk at very low bitrates and compensate with application-level controls

Error Handling

Limitations

• Semantic encoding is fundamentally hard to eliminate. Meaning-preserving encoding at 1–8 bits per response cannot be fully blocked without destroying the utility of the output. This is an inherent limit of any text-based defense.
• Prompting-only attacks have moderate reliability. Non-reasoning models achieve only 13–31% exact-match on bit propagation via prompting. The real threat comes from fine-tuned models (88–91% accuracy) or reasoning models (52–81%).
• Detection is asymmetric. Defenders must catch all encoding strategies; attackers only need one to succeed. New encoding schemes can be invented faster than detectors can be built.
• This skill focuses on defense and auditing, not on building implicit memory systems. The encoding techniques are described for understanding and red-teaming purposes only.
• The paper's experiments used specific models (GPT-4o, o3-mini, Qwen, Llama, Gemma). Results may differ on other architectures or future models.
