StepShield: Temporal Safety Monitoring for AI Agent Trajectories

This skill teaches Claude to build step-level safety monitoring systems for code agents using the StepShield methodology. Instead of binary pass/fail safety checks that only report violations after the fact, this approach implements cascaded detection that flags rogue behavior at or before the first violation step -- enabling real-time intervention. The core insight: a detector that catches a violation at step 8 allows you to stop the agent; one that reports it at step 48 is forensic evidence, not protection.

When to Use

• When the user asks to build a safety monitor, guardrail, or watchdog for an autonomous code agent (e.g., a coding assistant, CI/CD bot, or SWE-agent)
• When the user wants to detect rogue agent behavior such as unauthorized file access, secret exfiltration, resource abuse, test manipulation, or deceptive completion
• When the user needs to add step-by-step runtime intervention to an existing agent loop (ReAct, tool-use, or chain-of-thought agents)
• When the user wants to reduce monitoring costs by cascading cheap-then-expensive detectors rather than running an LLM judge on every step
• When the user asks to evaluate or benchmark the timeliness of a safety detector, not just its accuracy
• When building a production agent system that needs to halt execution before damage compounds

Key Technique

The HybridGuard Cascade. StepShield's core contribution is a three-stage cascaded detector that routes each agent step through increasingly expensive checks, exiting early when confidence is high:

1. StaticGuard (Stage 1): Regex and keyword pattern matching (<1ms). Catches obvious violations like rm -rf /, raw credential access patterns (os.environ["SECRET"]), or known destructive commands. Cheap but brittle -- achieves only 26% Early Intervention Rate (EIR).
2. ConstraintGuard (Stage 2): Rule-based validation against explicit constraints (~5ms). Checks file access boundaries, API rate limits, and scope violations. Catches "clear" violations that follow recognizable structural patterns.
3. LLMJudge (Stage 3): Semantic evaluation via an LLM (~500ms). Triggered only when Stages 1-2 produce confidence below threshold theta (default: 0.7). Catches subtle multi-step reasoning violations. Achieves 59% EIR alone but costs ~7x more per trajectory.

The cascade reduces monitoring cost by 75% compared to running LLMJudge on every step because most benign steps are cleared cheaply at Stages 1-2. Only ambiguous steps escalate to the expensive LLM call.

Three Temporal Metrics. Standard accuracy conflates early and late detection. StepShield introduces: (1) Early Intervention Rate (EIR) = fraction of rogue trajectories detected at or before the first violation step; (2) Intervention Gap (IG) = average steps between first rogue action and detection (perfect = 0); (3) Tokens Saved = percentage of tokens not processed because execution was halted early. These metrics reveal that a detector with 63% accuracy but 59% EIR is far more useful in production than one with 56% accuracy and 26% EIR.

2. StaticGuard clears ~70% of steps at near-zero cost (<1ms, no API call)
3. ConstraintGuard clears another ~15% at ~5ms each
4. Only ~15% of steps escalate to LLMJudge ($0.003/trajectory avg)

Best Practices

Do:

• Always run StaticGuard first -- it catches ~30% of obvious violations for free and keeps latency under 1ms for benign steps
• Use a sliding context window of 5 prior steps when calling LLMJudge (the paper found this optimal; longer windows add cost without improving EIR)
• Measure EIR, not just accuracy. A detector with 60% accuracy and 59% EIR is more useful than one with 70% accuracy and 26% EIR
• Set severity levels (L1=obvious, L2=clear, L3=subtle) and tune your cascade threshold per level -- lower theta for subtle categories to escalate more aggressively
• Log the Intervention Gap for every detected violation to track whether your detector is improving over time
• Include DEC (Deceptive Completion) patterns -- agents claiming "done" while leaving stubs is one of the most common rogue behaviors

Avoid:

• Running LLMJudge on every step unconditionally -- this is 7x more expensive and only marginally more accurate than HybridGuard
• Using only binary accuracy to evaluate your detector -- the paper shows a 2.3x EIR gap that is completely invisible to accuracy metrics
• Setting theta too high (>0.85) -- this causes the cascade to almost never reach LLMJudge, missing subtle violations
• Ignoring the realistic base rate -- rogue trajectories are ~8% of traffic; if your detector has high false positive rates, alert fatigue will overwhelm the true positives

Error Handling

• False positives on benign steps: If StaticGuard regex matches legitimate code (e.g., a tutorial about rm -rf), ConstraintGuard should clear it by verifying the action isn't actually executed. If false positive rate exceeds 5%, tighten regex patterns or raise theta.
• LLMJudge API failures: Fall back to StaticGuard + ConstraintGuard only. Log the gap in coverage. Never silently skip monitoring.
• Context window unavailable: If fewer than 5 prior steps exist (early in trajectory), pass all available steps. LLMJudge degrades gracefully with less context.
• Cascade latency spikes: If Stage 3 latency exceeds 2s (LLM provider slowdown), implement a timeout and flag the step as "unverified" for async review rather than blocking the agent indefinitely.
• Novel attack patterns: Static patterns cannot catch zero-day rogue behaviors. If EIR drops over time, retrain StaticGuard patterns on newly labeled violations and lower theta to escalate more to LLMJudge.

Limitations

• Subtle multi-step violations (L3 severity) remain hard: even LLMJudge only catches 59% at intervention time. Violations requiring reasoning across 10+ steps may not be detected early enough.
• Domain-specific tuning required. The six rogue categories (UFO, SEC, RES, INV, TST, DEC) cover code agents well but may need extension for other agent types (browsing agents, API agents).
• The 8.1% rogue rate assumption reflects the paper's test set. Your production rogue rate may differ significantly, affecting precision/recall tradeoffs.
• Token cost estimates assume quadratic attention complexity. If your agent uses a model with sub-quadratic attention, the "Tokens Saved" economic benefits will be smaller.
• HybridGuard's 41% EIR means 59% of rogue trajectories are still not caught early enough for intervention. This is a monitoring layer, not a guarantee -- defense in depth is still required.
